Every AI project that delivers real ROI has three key characteristics. Miss any one of them, and you're just gambling on luck.

Clean, accessible data.

This is the unglamorous foundation that everyone wants to avoid. AI models are pattern-recognition engines. Feed them garbage, and they recognize garbage patterns. Feed them incomplete data, and they make incomplete predictions. No algorithm is clever enough to fix a data warehouse that looks like a junk drawer.

A specific, measurable problem.

"We want to use AI" is not a business case. "We want to reduce invoice processing time from 4 hours to 20 minutes" is. The difference matters. Vague goals lead to vague projects that drift until someone eventually pulls the budget.

A clear definition of success.

Before writing a single line of code, you need to understand what "working" looks like. Not "the model is accurate." Accurate at what? Measured how? Compared to what baseline? If you can't answer these questions upfront, you'll never know if you succeeded. And neither will your CFO.

Red Flags That Should Kill a Project

Some AI initiatives are doomed from the start. Here's how to spot them early, before they waste six months and a quarter million dollars.

Solution looking for a problem.

"Our competitors are using AI, so we need AI." This is fear disguised as strategy. If you can't clearly state the specific business outcome in one sentence, stop. Identify an actual problem first.

Skipping data quality.

The most common failure mode. Teams get excited about the AI part and treat data preparation as a speed bump. It's not a speed bump. It's the road. Skip it, and you're driving through a field.

No success metrics defined.

If the project sponsor can't define what success looks like clearly, the project will only succeed in the sense that it eventually concludes.

Vendor-driven scope.

When the AI vendor defines the use case, it often leads to a solution looking for a problem. These rarely align as perfectly as sales materials imply.

The "boil the ocean" timeline.

Eighteen-month AI transformations have an almost perfect failure rate. Not because the vision is wrong, but because organizations change, priorities shift, and people lose patience. If you can't demonstrate value in 90 days, the project probably won't succeed.

Three AI Categories That Actually Work

After observing many projects succeed and fail, the winners fall into three groups. These aren't glamorous. They won't make headlines. But they work.

Data quality automation.

Ironically, AI is being used to fix data issues that cause AI to malfunction. Yet, it proves effective. Automated systems detect anomalies, identify duplicates, and apply standardization rules that learn from past corrections. These initiatives usually pay for themselves within months by addressing a tangible problem: messy data that's costly to clean manually. The secret lies in agents that can think through data chaos like humans but operate at machine speed.

Decision support systems.

Note: support, not replacement. The most effective AI tools enhance human judgment instead of replacing it. For example, predictive maintenance systems guide technicians to prioritize which machine to inspect first. Customer scoring aids sales teams in focusing their outreach efforts. Fraud detection systems flag transactions for further human review. Overall, these systems improve human performance, which is a clear and widely recognized value.

Workflow automation.

Automating repetitive, rule-based tasks to eliminate human bottlenecks. Examples include invoice processing, document classification, and extracting data from unstructured sources. The main point: these are tasks people already perform but do so slowly and costly. You're not creating new skills; you're enhancing current workflows.

A Framework for Vetting AI Opportunities

Before greenlighting any AI project, run it through these five questions:

  1. Can you describe the business outcome in a single sentence? If it takes a paragraph, the scope is too vague.
  2. What data is currently available, and what is its condition? An honest assessment is crucial. "Data exists somewhere" does not mean having clean, accessible data.
  3. What is the current process and its costs? A clear baseline is needed to measure progress.
  4. Can you demonstrate value within 90 days? If not, break the project into smaller sections until you can.
  5. Who is responsible for the outcome? Ownership should be connected to business results, not just technology. Without direct responsibility, success is unlikely.

If a project passes all five, it's worth pursuing. If any of them fail, address that issue before investing money.

The Honest Path Forward

AI produces results, but only under certain conditions that many organizations haven't yet set up.

The path forward isn't about more advanced algorithms or bigger language models. It's about making honest assessments of readiness. It's about building strong foundations before chasing headlines. It's about choosing boring projects with clear ROI over flashy demos that never scale.

Most companies will ignore this advice. They will chase after the shiny new things, use up their budgets, and blame the technology when it fails. Then they declare that AI is overhyped.

Meanwhile, the boring companies (the ones that fixed their data first, chose specific problems, and measured results) will quietly pull ahead. They won't make headlines. They'll just generate profit.
